重新审视图神经网络中的异质性

摘要

图神经网络(GNNs)通过基于关系归纳偏置(同质性假设)的图结构扩展了基本的神经网络(NNs)。尽管GNNs通常被认为在实际任务中优于NNs,但近期的研究发现,在某些数据集中,GNNs的表现并不令人满意。异质性被认为是导致这一实证观察的主要原因,许多研究工作已经提出了解决这一问题的方法。本文首先重新审视了广泛使用的同质性度量指标,并指出这些指标仅考虑图标签一致性是一个不足之处。随后,我们从聚合后节点相似性的角度研究了异质性,并定义了新的同质性度量指标,这些新指标可能比现有的度量指标更具优势。基于这一研究,我们证明了一些有害的异质性情况可以通过局部多样化操作得到有效解决。接着,我们提出了自适应通道混合(Adaptive Channel Mixing, ACM),这是一种框架,可以自适应地利用聚合、多样化和身份通道逐节点提取更丰富的局部信息,以应对多样化的节点异质性情况。ACM在异质图上的节点分类任务中比常用的单通道框架更强大,并且易于在基础GNN层中实现。在10个基准节点分类任务上的评估表明,增强ACM的基础模型始终表现出显著的性能提升,在大多数任务上超过了最先进的GNNs,而不会带来显著的计算负担。
